🤖 AI Model Deep Dive

Hybrid Forecasting Engine

The engine combines three approaches using a weighted ensemble to balance reactivity, trend projection, and non-linear pattern capture:

Model Weight Approach Strength
EMA 35% Exponential Moving Average (α=0.3) Fast response to recent workload shifts
Linear Regression 35% Ordinary Least Squares on time series Directional trend extrapolation
LSTM Trend 30% Forget/input/output gates, sigmoid + tanh Non-linear temporal pattern capture

Final Prediction = 0.35 × EMA + 0.35 × LR + 0.30 × LSTM

LSTM-Inspired Trend Simulator

For each data point in 10-point sliding window:
  forget_gate  = σ(point × 0.5 + hidden_state × 0.5)
  input_gate   = σ(point × 0.5 + hidden_state × 0.3)
  candidate    = tanh(point × 0.5 + hidden_state × 0.5)
  cell_state   = forget_gate × cell_state + input_gate × candidate
  output_gate  = σ(point × 0.5 + hidden_state × 0.5)
  hidden_state = output_gate × tanh(cell_state)

Confidence Score

confidence = sampleFactor(40%) + cpuStability(30%) + memoryStability(30%)

sampleFactor  = min(sampleSize / 50, 1.0) × 40
cpuStability  = max(0, 1 - cpuStdDev / 50) × 30
memStability  = max(0, 1 - memStdDev / 50) × 30

🎯 Interview Prep

Q: What AI model did you use and why?

I implemented a hybrid forecasting engine that combines three models in a weighted ensemble:

  • Exponential Moving Average (35%) for capturing recent trends with a 0.3 smoothing factor — it reacts quickly to workload spikes
  • Linear Regression (35%) using ordinary least squares — it projects directional growth or decline over the data window
  • LSTM-inspired Trend Simulator (30%) with forget, input, and output gates using sigmoid and tanh activations on a 10-point sliding window — it captures non-linear temporal patterns that EMA and LR miss

I chose this ensemble approach because no single model handles all workload patterns well. EMA reacts to recent changes but can overfit to noise, LR captures trends but assumes linearity, and the LSTM simulator handles complex patterns. The weighted combination delivers more stable and accurate predictions.

The confidence score is computed from three factors: sample size (40%), CPU variance stability (30%), and memory variance stability (30%).

Q: How did you train the model?

The model uses online learning — it trains on-demand each time the forecasting endpoint is called. It pulls the last 100 data points for the requested resource from MongoDB and runs the hybrid model:

  • The EMA iterates through the time series applying exponential smoothing
  • The Linear Regression fits OLS coefficients across the dataset
  • The LSTM simulator processes the most recent 10 data points through gate operations

The Pinecone vector store continuously indexes 8-dimensional workload signatures as metrics arrive. When you query for similar workloads, it computes cosine similarity against all stored vectors and returns the top-K matches with pattern classifications and recommended actions.

This approach means the model always uses the latest data without requiring batch retraining.

Q: How does the cost optimization work?

The cost optimization service analyzes per-resource utilization patterns:

  1. Calculates current monthly cost based on on-demand pricing ($0.096/hr baseline)
  2. Determines optimized cost using reserved/spot instance pricing ($0.0576/hr)
  3. Detects wasted resources — time periods where CPU utilization falls below thresholds
  4. Applies a 40% reduction target floor to ensure meaningful savings recommendations
  5. Generates an optimization strategy string explaining whether to right-size, switch to reserved instances, or terminate idle resources

The dashboard aggregates these per-resource analyses into total current cost, optimized cost, savings percentage, and annualized projected savings.

Q: What is the Pinecone vector search doing?

The vector search system creates 8-dimensional embeddings for each resource's workload profile. The dimensions capture normalized averages of CPU, memory, max CPU, max memory, network I/O, disk read, and active connections.

When you query for similar workloads, it computes cosine similarity between the query resource's vector and all stored vectors, returning the top-K most similar resources. Each match includes:

  • Similarity score (0–1)
  • The matched resource's average CPU and memory
  • A pattern classification (e.g., "cpu-intensive", "balanced")
  • A recommended action based on the matched pattern

This enables knowledge transfer — if a similar workload was optimized before, the system recommends the same strategy for the current resource.
